Bias, Fairness, and Explainability
Understanding AI Bias
AI bias occurs when a system produces systematically unfair outcomes. Bias can enter a system through training data, data collection methods, feature selection, labeling decisions, or the way a model is deployed.
Common sources include:
- Historical bias: Training data reflects past discrimination or unequal opportunities.
- Representation bias: Some groups are underrepresented in the dataset.
- Measurement bias: Data is collected or measured differently across groups.
- Evaluation bias: Testing data does not adequately represent the people who will use the system.
For instance, a face recognition model trained primarily on images from one demographic group may perform less accurately for other groups.
How to Reduce Bias
Developers can take several steps to identify and reduce bias:
- Examine datasets for missing groups, inaccurate labels, and unbalanced representation.
- Evaluate model performance across relevant demographic groups.
- Use appropriate sampling, data collection, or modeling techniques to address identified problems.
- Review results with domain experts and affected stakeholders.
- Continue monitoring the system after deployment.
Fairness cannot always be represented by a single metric. Different fairness criteria may conflict, so developers must consider the application's context and potential consequences.
Explainability and Interpretability
Explainability refers to methods that help people understand why an AI system produced a particular output. Interpretability generally describes how directly a model's behavior can be understood.
For example, a simple decision tree may show that a loan application was rejected because of specific financial criteria. A more complex model may require explanation techniques that estimate which features influenced its prediction.
Explainability is especially important in areas such as healthcare, finance, recruitment, and public services, where decisions can significantly affect people's lives.
