Anomaly Detection
What Is Anomaly Detection?
Anomaly detection identifies observations that differ substantially from the normal patterns in a dataset.
Anomalies may indicate:
- Unusual financial transactions.
- Equipment malfunction.
- Unexpected network activity.
- Errors in sensor measurements.
- Abnormal application behavior.
An anomaly is not necessarily an error or a fraudulent event. It is an observation that deserves further investigation.
Understanding Isolation Forest
Isolation Forest is an algorithm designed to detect unusual observations by isolating data points through randomly selected features and split values.
Anomalies are often easier to isolate than typical observations because they differ from the majority of the data.
Isolation Forest is useful for numerical datasets and does not require labeled examples of every anomaly.
Implementing Isolation Forest
from sklearn.ensemble import IsolationForest
# Illustrative measurements
X = [
[20, 200],
[21, 210],
[19, 195],
[22, 205],
[20, 198],
[21, 202],
[200, 2000]
]
model = IsolationForest(
contamination=0.15,
random_state=42
)
model.fit(X)
predictions = model.predict(X)
for point, prediction in zip(X, predictions):
status = "Anomaly" if prediction == -1 else "Normal"
print(point, status)Understanding the Parameters and Output
- contamination estimates the proportion of anomalies expected in the training data and influences the decision threshold.
- random_state makes the randomized procedure reproducible.
- A prediction of 1 indicates a normal observation under the fitted model.
- A prediction of -1 indicates a detected anomaly.
The contamination value should be chosen carefully. Setting it too high may flag too many normal observations, while setting it too low may miss unusual points.
Challenges in Anomaly Detection
Anomaly detection can be difficult because normal behavior may change over time, rare legitimate events may resemble suspicious activity, and labeled examples may be unavailable.
In real applications, anomaly scores should be combined with domain knowledge, appropriate thresholds, and human investigation where necessary.
